Multi-Modal Recurrent Attention Networks for Facial Expression Recognition

Recent deep neural networks based methods have achieved state-of-the-art performance on various facial expression recognition tasks. Despite such progress, previous researches for facial expression recognition have mainly focused on analyzing color recording videos only. However, the complex emotions expressed by people with different skin colors under different lighting conditions through dynamic facial expressions can be fully understandable by integrating information from multi-modal videos. We present a novel method to estimate dimensional emotion states, where color, depth, and thermal recording videos are used as a multi-modal input. Our networks, called multi-modal recurrent attention networks (MRAN), learn spatiotemporal attention volumes to robustly recognize the facial expression based on attention-boosted feature volumes. We leverage the depth and thermal sequences as guidance priors for color sequence to selectively focus on emotional discriminative regions. We also introduce a novel benchmark for multi-modal facial expression recognition, termed as multi-modal arousal-valence facial expression recognition (MAVFER), which consists of color, depth, and thermal recording videos with corresponding continuous arousal-valence scores. The experimental results show that our method can achieve the state-of-the-art results in dimensional facial expression recognition on color recording datasets including RECOLA, SEWA and AFEW, and a multi-modal recording dataset including MAVFER.

Emotion Detection and Recognition based on Brain and Peripheral Physiological Signals

Emotions affect and determine social relationships and interactions, memory and creativity, and influence the mechanisms of rational thinking and decision making. The influence of emotion on decision making has gained attention in computer science. By detecting and recognizing emotions in an automatic way, machines endeavor to ease interaction between users and multimedia content. Automatic emotion detection and recognition can be carried out through analysis of users' various behavioural, and physiological signals such as electroencephalogram (EEG), electrocardiogram (ECG), electrodermal activity (EDA), and respiration, among others. These modalities have been extensively studied individually. However, since different individuals may experience the same emotion but express it differently, the various modalities are considered complementary, and fusion of various physiological and behavioural responses is expected to improve the quality of emotion recognition systems. Nevertheless, although representative features and their multimodal integration have been studied in affective computing research for various applications, patterns that arise from the dynamic interrelation among various modalities during emotional processes have received less attention. By summarizing each physiological signal only in a number of features, one may lose information present in the underlying dynamical co-evolution of various physiological signals. Considering all these issues, this thesis aims at detecting and recognizing emotion through brain and peripheral signals, targeting three complementary topics that have not been thoroughly explored. The first one includes emotion assessment from music video clips, the second one emotion assessment from odors, and the third one Quality of Experience (QoE) assessment from two-dimensional (2D) and three-dimensional (3D) video contents, using in all cases brain and peripheral physiological signals. Regarding emotion assessment from music video clips, subject-dependent and subject-independent analyses are carried out in this thesis, and the results reveal that although there are differentiations among the subjects' brain activation patterns, there are still common patterns across them. Moreover, the dynamical co-evolution between EEG and EDA is explored during emotional processes, and the results reveal that the coupling between EDA and EEG of the temporal lobe increases when strong emotions occur with respect to neutral ones. Finally, possible clustering patterns across subject-categories are investigated, and the results reveal that there are common characteristics across subject-categories related to their emotions. Regarding emotion assessment from odors, since the primary response to odors is related to pleasantness perception, which has not yet been thoroughly investigated, this thesis explores the way perceived odor pleasantness influences brain and periphery. In particular, two independent classifiers are trained and tested, one using EEG and the other using ECG features. The results reveal that it is possible to assess odor pleasantness perception from EEG and less accurately from ECG features, in a subject-independent framework. Also, decision fusion of the EEG and ECG classifiers is shown to discriminate odor pleasantness perception. Moreover, in order to explore the dynamical co-evolution between brain and peripheral signals, the coupling between heart rate and EEG is investigated. The results reveal that there is a significant increase in the coupling between ECG and temporal lobe EEG, when pleasant or unpleasant odors are experienced with respect to neutral ones. Enhanced QoE from multimedia contents targets to increase users' sensation of reality, in order to induce stronger emotions and render the user more involved in the experience. In this thesis, QoE is investigated in terms of four aspects, namely perceived depth, perceived overall quality, content preference, and sensation of reality. In particular, it is revealed that it is possible to recognize perceived depth, content preference, and sensation of reality from EEG signals, but not from the peripheral ones. Also, fusion between peripheral and EEG features is found to improve the performance in some cases. Finally, the left frontal cortex seems to be activated when sensation of reality is high, indicating that high sensation of reality is related to approach-related emotional processes. Although the three topics are independently explored in this thesis, their potential integration would endeavor to create immersive multimedia systems, which could adapt their properties according to users' emotions, and enhance, thus, user-experience.

Automatic social role recognition and its application in structuring multiparty interactions

Automatic processing of multiparty interactions is a research domain with important applications in content browsing, summarization and information retrieval. In recent years, several works have been devoted to find regular patterns which speakers exhibit in a multiparty interaction also known as social roles. Most of the research in literature has generally focused on recognition of scenario specific formal roles. More recently, role coding schemes based on informal social roles have been proposed in literature, defining roles based on the behavior speakers have in the functioning of a small group interaction. Informal social roles represent a flexible classification scheme that can generalize across different scenarios of multiparty interaction. In this thesis, we focus on automatic recognition of informal social roles and exploit the influence of informal social roles on speaker behavior for structuring multiparty interactions. To model speaker behavior, we systematically explore various verbal and non verbal cues extracted from turn taking patterns, vocal expression and linguistic style. The influence of social roles on the behavior cues exhibited by a speaker is modeled using a discriminative approach based on conditional random fields. Experiments performed on several hours of meeting data reveal that classification using conditional random fields improves the role recognition performance. We demonstrate the effectiveness of our approach by evaluating it on previously unseen scenarios of multiparty interaction. Furthermore, we also consider whether formal roles and informal roles can be automatically predicted by the same verbal and nonverbal features. We exploit the influence of social roles on turn taking patterns to improve speaker diarization under distant microphone condition. Our work extends the Hidden Markov model (HMM)- Gaussian mixture model (GMM) speaker diarization system, and is based on jointly estimating both the speaker segmentation and social roles in an audio recording. We modify the minimum duration constraint in HMM-GMM diarization system by using role information to model the expected duration of speaker's turn. We also use social role n-grams as prior information to model speaker interaction patterns. Finally, we demonstrate the application of social roles for the problem of topic segmentation in meetings. We exploit our findings that social roles can dynamically change in conversations and use this information to predict topic changes in meetings. We also present an unsupervised method for topic segmentation which combines social roles and lexical cohesion. Experimental results show that social roles improve performance of both speaker diarization and topic segmentation.

Using Photorealistic Face Synthesis and Domain Adaptation to Improve Facial Expression Analysis

Cross-domain synthesizing realistic faces to learn deep models has attracted increasing attention for facial expression analysis as it helps to improve the performance of expression recognition accuracy despite having small number of real training images. However, learning from synthetic face images can be problematic due to the distribution discrepancy between low-quality synthetic images and real face images and may not achieve the desired performance when the learned model applies to real world scenarios. To this end, we propose a new attribute guided face image synthesis to perform a translation between multiple image domains using a single model. In addition, we adopt the proposed model to learn from synthetic faces by matching the feature distributions between different domains while preserving each domain’s characteristics. We evaluate the effectiveness of the proposed approach on several face datasets on generating realistic face images. We demonstrate that the expression recognition performance can be enhanced by benefiting from our face synthesis model. Moreover, we also conduct experiments on a near-infrared dataset containing facial expression videos of drivers to assess the performance using in-the-wild data for driver emotion recognition.
